âš¡ Incident Summary: Resolving Lakehouse Schema Corruption

During an hourly ETL conversion job from raw S3 JSON to columnar Parquet in AWS Athena, query workers threw fatal HIVE_BAD_DATA: Field metadata cannot be parsed as struct errors. Inspecting the failing partition with JSON Tree Viewer revealed that a legacy firmware update serialized empty sensor metadata as the 4-character string "null" instead of native RFC 8259 null. The visualizer allowed engineers to formulate an exact PySpark sanitization rule within minutes, unblocking 1.4 million stalled records.

1. The Lakehouse Ingest Pipeline Architecture

The engineering organization streams telemetry from 250,000 active smart-grid sensors. The data pipeline follows standard lakehouse best practices:

  • Sensors post gzipped JSON batches to an Amazon API Gateway.
  • Kinesis Firehose buffers events into an Amazon S3 Bronze raw bucket.
  • Hourly AWS Glue / Athena jobs convert Bronze JSON into Silver columnar Parquet for analytics querying in Snowflake and Tableau.

2. The Failure: HIVE_BAD_DATA Ingest Halts

At 03:00 AM, the Athena Parquet conversion job failed with:

[ERROR] HIVE_BAD_DATA: Cannot cast STRING to struct<temp:double,voltage:double> for column context.metadata (path: s3://telemetry-lake/2026/11/01/03/batch_49.json.gz)

Because the table schema defined context.metadata as a nested struct, Athena halted execution across the entire partition to prevent silent data corruption.

3. Visual Graph & Tree Isolation

The on-call data engineer extracted a 50-record sample from the offending S3 key and dropped it into JSON Tree Viewer:

  • 98% of records showed metadata as an expandable Object branch containing numeric readings.
  • In 2% of records, metadata was rendered with an amber badge indicating a String literal: "null".
  • The contrast between gray/slate native null and quotation-wrapped amber "null" instantly revealed the root cause.

4. The "null" String vs Native Null Bug

An over-the-air firmware update in an older device model contained a serialization bug in C: instead of outputting literal null when sensor probes disconnected, snprintf(buf, len, "\"%s\"", "null") wrapped the keyword in double quotes. In strict schema formats like Parquet, strings cannot coerce into nested struct definitions.

5. The PySpark Healing Patch

# PySpark Ingestion Transformation to sanitize corrupted "null" strings
from pyspark.sql.functions import col, when

df_clean = df_raw.withColumn(
"context.metadata",
when(col("context.metadata") == "null", None)
.otherwise(col("context.metadata"))
)
